Machine Learning Data Leakage: Split Before Fitting Preprocessing
Before comparing algorithms, define what information each stage is allowed to learn from. Use a small synthetic modelling exercise to distinguish fitting a transformation from applying one that has already been fitted. The goal is a defensible experiment boundary, not an impressive-looking score or a claimed real-world outcome.
Define the prediction moment
Write the target and describe when a prediction would be made. List which candidate inputs would be known at that moment. Exclude a field that only becomes available after the outcome, even if it appears useful during offline exploration.
Use synthetic records without personal details. Add an ID and, if relevant to your imagined task, a group or time field. The exercise notes should explain the independence assumptions rather than treating every row as an unrelated observation by default.
Choose the evaluation boundary before learning settings
Separate the held-out portion before fitting preprocessing that learns from data. State why the split represents the intended future use. When records are related or time-ordered, a simple random row split may not answer the question you intended.
Record which rows belong to each portion so the experiment can be reproduced. A fixed random seed can support repeatability, but it does not establish that the chosen split strategy is appropriate for the underlying task.
Distinguish fitting from transforming
A scaler or imputer can learn parameters from its input. Fit those parameters using training data, then apply the fitted transformation to the held-out data. Do not recompute them on the complete dataset before the split.
For a simple paper check, put training values 0 and 10 in one portion and held-out value 100 in the other. The training mean is 5; the mean of all three values is different. Use that difference to explain why a fitted setting can reveal information about the evaluation portion.
Keep preprocessing inside the experiment workflow
Use an appropriate pipeline to connect learned preprocessing with the estimator. During model selection, fit preprocessing within the relevant training folds rather than using statistics calculated from the whole dataset in advance.
Keep a separate record of tuning decisions. Repeatedly inspecting a held-out result and adjusting the model in response can undermine the role you assigned to that held-out portion. Decide the validation and final-evaluation roles before experimenting.
Review the experiment record
- Features are available at the stated prediction moment.
- The split strategy matches the task’s group or time structure.
- Learned preprocessing sees only the relevant training data.
- The fitted workflow is applied consistently to held-out data.
- Any score is accompanied by the split design and limitations.
Explain the evidence without inflating the claim
A small synthetic exercise can show that you understand the workflow boundary. It cannot establish future accuracy, deployment readiness or an employment outcome.
